Inspiration

Financial fraud through mule accounts has become one of the biggest challenges for banks and regulatory agencies. Traditional rule-based fraud detection systems struggle to detect sophisticated mule networks, generate high false positives, and cannot identify evolving fraud patterns. This inspired us to build MuleGuard-AI, an intelligent AI-powered platform that combines machine learning, graph analytics, and explainable AI to detect mule accounts in near real time.

What it does

MuleGuard-AI detects mule bank accounts involved in financial fraud by analyzing transaction behavior, fraud alerts, regulatory feeds, and cross-bank data. It extracts behavioral and graph-based features, assigns a real-time risk score to every account, explains every prediction using SHAP, and recommends actions such as Block, Review, Monitor, or Allow. The platform also detects mule chains using graph analysis and provides an interactive monitoring dashboard.

How we built it

We developed MuleGuard-AI using Python with an ensemble of LightGBM, XGBoost, and CatBoost models. We engineered behavioral and graph-based features using NetworkX, processed data using Pandas, NumPy, and Scikit-learn, implemented explainability using SHAP, built REST APIs with FastAPI, designed dashboards using Streamlit, and planned a production pipeline using Apache Kafka, Apache Flink, and Redis for real-time inference.

Challenges we ran into

Our biggest challenge was handling the extreme class imbalance, where only a small fraction of accounts were fraudulent. Designing meaningful behavioral and graph features, reducing false positives, achieving real-time inference, and ensuring model explainability while maintaining high prediction accuracy were also significant technical challenges.

Accomplishments that we're proud of

We built a complete end-to-end fraud detection architecture capable of detecting mule accounts using AI, graph analytics, and explainable AI. Our ensemble model achieved an AUC-ROC of 0.9944, 96.3% precision, 97.5% recall, and real-time inference in under 50 milliseconds. The system also provides transparent predictions and supports regulatory compliance through detailed explanations.

What we learned

Through this project, we gained practical experience in machine learning, feature engineering, graph analytics, explainable AI, fraud detection, model deployment, and API development. We also learned the importance of balancing prediction accuracy, inference speed, scalability, and interpretability for real-world financial security applications.

What's next for MuleGuard-AI

Our next goal is to deploy MuleGuard-AI in a cloud-native environment with live banking transaction streams. We plan to integrate federated learning for privacy-preserving cross-bank collaboration, enhance graph intelligence for detecting larger fraud networks, support additional regulatory systems, and continuously improve the model to detect emerging financial fraud patterns with even greater accuracy.
