Inspiration
Modern cloud infrastructure is becoming increasingly complex. Organizations must constantly balance infrastructure cost, security, reliability, and operational safety. Existing optimization tools are largely rule-based and struggle when multiple objectives conflict. A decision that reduces cost today may introduce security vulnerabilities or trigger cascading failures tomorrow.
We wanted to explore whether AI agents could learn these trade-offs instead of relying on manually engineered rules. This inspired us to build CloudArena AI, a realistic cloud operations environment where reinforcement learning agents and language models learn to make safe operational decisions under real-world constraints.
What it does
CloudArena AI is an intelligent cloud operations platform that trains AI agents to optimize infrastructure while maintaining production safety.
The platform simulates realistic cloud environments containing virtual machines, databases, caches, storage systems, queues, and dependency graphs. Instead of optimizing for cost alone, agents must simultaneously improve:
- Infrastructure cost efficiency
- Security posture
- Service reliability
- Operational safety
The project contains two complementary AI approaches:
- Math RL – A MaskablePPO reinforcement learning agent that learns directly from structured numerical observations.
- LLM RL – A custom GRPO-based pipeline where a language model reasons over cloud state descriptions and produces structured JSON actions.
Both agents operate in the same environment, allowing direct comparison between structured reinforcement learning and language-based reasoning.
How we built it
The project was built using Python, PyTorch, Gymnasium, Stable-Baselines3, SB3-Contrib, Transformers, vLLM, and Gradio.
The environment models cloud infrastructure as interconnected resources with operational attributes including cost, health, utilization, security risk, dependency relationships, encryption status, credential age, and service criticality.
We designed a multi-objective reward system that balances:
- Cost optimization
- Security improvement
- Reliability preservation
- Safe infrastructure management
To prevent unsafe optimization, we implemented safety guardrails that validate every action before execution. Critical resources cannot be deleted, dependency-aware restrictions prevent cascading failures, and emergency safety mechanisms intervene during high-risk operational states.
One of the unique aspects of our environment is an immune-inspired memory mechanism that remembers recurring failure patterns and increases attention to repeated operational risks, making future scenarios more realistic.
The platform also includes deterministic benchmarking, curriculum learning, evaluation dashboards, and real-time monitoring for analyzing training progress.
Challenges we ran into
The most difficult challenge was balancing multiple competing objectives. Maximizing cost savings alone often encouraged unsafe decisions, while prioritizing security reduced optimization opportunities.
Designing a reward function that encouraged long-term planning instead of short-term gains required extensive experimentation.
Another challenge was creating an environment that could fairly evaluate both structured reinforcement learning agents and language-model-based agents under identical operational constraints.
Building realistic dependency graphs, safety validation, curriculum progression, and environment memory while maintaining stable training required significant engineering effort.
Accomplishments that we're proud of
- Built a realistic cloud operations simulator instead of a toy RL environment.
- Successfully integrated both reinforcement learning and LLM-based policy optimization into one platform.
- Designed a multi-objective reward system balancing cost, security, and reliability.
- Implemented action masking, safety guardrails, dependency-aware execution, and deterministic benchmarking.
- Created an immune-inspired environment memory system that models recurring operational failures.
- Developed an interactive Gradio interface for training, benchmarking, and live monitoring.
What we learned
This project reinforced that real-world AI systems require much more than accurate models. Success depends equally on environment design, reward engineering, safety constraints, evaluation methodology, and explainability.
We also learned that reinforcement learning and language models have complementary strengths. Structured RL excels at optimizing numerical state spaces, while LLMs provide interpretable reasoning and structured decision-making. Combining both approaches opens exciting possibilities for future intelligent cloud operations.
What's next for CloudArena AI
Our next goal is to expand CloudArena AI into a more comprehensive cloud operations benchmark.
Future work includes:
- Multi-cloud support (AWS, Azure, and Google Cloud)
- More realistic incident simulations
- Auto-scaling and workload migration policies
- Human-in-the-loop feedback for safer decision making
- Offline preference optimization using DPO datasets
- Larger benchmark scenarios with hundreds of cloud resources
- Integration with real cloud monitoring data for hybrid simulations
Ultimately, we hope CloudArena AI can become a practical research platform for developing safe AI systems capable of assisting engineers in managing modern cloud infrastructure.
